Overview

This research introduces X-RACE, an explainable AI (XAI)-assisted framework designed for recurrent neural network attribution in channel estimation tasks, specifically targeting high-mobility vehicular environments. X-RACE addresses limitations associated with the black-box nature and architectural overhead of deep learning models, such as Long Short-Term Memory (LSTM) networks, which have demonstrated performance in this domain. The framework aims to enhance efficiency and trustworthiness by combining simultaneous evaluation and pruning of network components.

Research Context

Deep learning models, particularly LSTMs, have shown promise in channel estimation within high-mobility vehicular settings. However, their inherent black-box characteristic and the architectural complexity present challenges concerning trustworthiness and efficiency. Existing classical XAI methods often depend on iterative processes, incur significant computational costs, and typically provide input-level filtering without addressing the fine-tuning of the model's internal architecture. These methods do not offer solutions for optimizing the model's internal structure for efficiency.

Approach

The X-RACE framework employs a low-complexity, one-shot dual-optimization strategy. This strategy is designed to concurrently evaluate and prune two specific types of components within the LSTM network: irrelevant input subcarriers and internal hidden units. This dual optimization aims to streamline the model by removing parts deemed non-essential for its performance. Furthermore, the researchers propose three novel temporal XAI metrics to characterize the dynamic learning behavior and memory convergence of LSTMs:

  • Saturation Time
  • Importance Drift
  • Relevance Contrast

These metrics are intended to provide insights into how the LSTM learns and retains information over time.

Findings

Extensive simulations conducted to evaluate X-RACE demonstrated that the framework achieves a reduction in inference complexity of at least 44.1%. This reduction was observed while either improving or preserving the Bit Error Rate (BER) performance of the channel estimation task. The performance of X-RACE, in terms of both complexity reduction and BER, was found to surpass that of classical XAI schemes in the conducted simulations.

Why This Matters

The described approach contributes to addressing the trade-off between the performance benefits of deep learning models like LSTMs in channel estimation and their associated computational overhead and interpretability challenges. By reducing inference complexity while maintaining or improving performance, X-RACE offers a method for making these models more efficient and potentially more suitable for resource-constrained applications, such as those found in high-mobility vehicular environments.
